The challenge of scaling Generative AI pilots.
The journey from Proof of Concept (PoC) or Pilot to operationalising AI at scale is a significant challenge facing businesses today. While it is relatively straightforward to clean and constrain data for a POC, scaling these efforts into real-world operations is a more complex undertaking. There are many reasons for this failing (e.g. vendor hype, unrealistic expectations, wrong use-case), including these three core issues: (1) the quality and structure of data; (2) the absence of clear digital boundaries; (3) and the interplay between human and digital decision-makers. These challenges aren't just technological; they require integrating AI into core operations—a significant undertaking.
The first hurdle is data. In a POC or pilot, data is often curated, clean, and well-structured, a controlled environment that rarely reflects the messy reality of enterprise operations. Scaling AI systems requires managing massive data volumes, diverse formats, and constantly evolving data landscapes. Integration with legacy systems adds another layer of complexity, as does ensuring sustainability and cost-effectiveness. Without an enterprise-wide strategy for data cleaning, governance, and guardrails, the AI initiative will quickly falter under the weight of these challenges.
Digital boundaries are the second critical element. For AI to function effectively and ethically, businesses must define not only the problems AI is meant to solve but also the boundaries of its influence. This means answering tough questions, for example: what data should AI use to make decisions, and what data should it ignore? What decisions can AI influence, and which must remain the purview of human employees? Such boundaries need to be clearly articulated, not just for human understanding but in ways that AI systems can interpret and abide by. Without these guardrails, trust in AI-driven decisions erodes, a risk no organisation can afford, especially if critical business decisions (e.g. loan approvals) are made made by AI.
The third challenge lies in the decision-making landscape, particularly the interplay between digital employees (AI systems) and their human counterparts. Decisions must be guided by a clear understanding of who—or what—is responsible. This necessitates a digital operating model that recognises AI’s role as an enabler within the organisation’s functional silos. AI systems in debt collection, for instance, will operate under entirely different rules and constraints than those in sales or supply chain management. Viewing AI through a business adoption lens is critical; too often, companies expect AI to be a panacea, only to be disappointed when it fails to deliver across disparate domains.
To effectively address these challenges, CEOs might want to explore the creation of a cohesive and transparent digital operating model. This exploration could include prioritising scalable and transparent data governance to ensure data quality, accessibility, and accountability, enforcing digital boundaries to manage risk and security, and defining clear and publicly understood roles for both AI and human decision-makers. By focusing on these foundational challenges related to data, boundaries, and decision-making, companies can move beyond small-scale experiments and realise the full potential of Gen AI at scale.
